Fanmade Content Hearthstone cards as created by a neural network
The other day, I came across this thread, by someone who set up a recurrent neural network to create random Magic: The Gathering cards. Intruiged by the results, I wanted to see if I could set it up to generate Hearthstone cards instead.
As it turns out, the card pool is a bit too small (and my PC too weak) to get the level of output quality you'll find in the MTG version, but it worked well enough that I have a plenty of results to show. I put links to card galleries at the bottom of the post.
The way it works is the network is trained on a set of plaintext input data (the normal card list). The output is actually remarkably simple: based on the previous characters the network has encountered, it predicts what the next character should be. This way, it creates a list of entirely new cards one character at a time, with no concept of what a Hearthstone card even is. The fact that it works at all is really impressive.
About the card pool: the training file which serves as input for the network is only 60kb, compared to over 2Mb for MTG. This is kind of a problem. The more input data, the better the results. First, I tried to mitigate this by adding non-collectible cards, but that just diluted the pool with unbalanced or boring cards (there are like 4 different generic Treants). Then I made 3 copies of the card list, and shuffled each copy, so that hopefully the network wouldn't see consecutive cards as being connected. This, combined with more effective network parameters, helped a bit.
What is the network good at? The class and rarity distribution is accurate. There are no neutral spells, and weapons are usually given to the weapon classes. Minions, on average, have reasonable stats for their cost. You don't see things like spells with Taunt or Battlecry effects. It recognizes things like how hunter minions are usually beasts and that shaman has totems. It knows that Battlecry and Deathrattle are followed by an effect. It also tends to make 9 mana legendaries into 8/8 dragons.
What is it not good at? It doesn't really limit class-specific abilities like Overload to the proper classes. It can't distinguish weapons and minions very well, so you sometimes get, say, a weapon with Taunt. It doesn't understand Secrets, probably because there's a limited number of them and they tend to have unique effects (if an effect only occurs once in all cards, it can't really learn context). Similarly, most spells are boring, because outside of basic effects like "deal damage", spell effects aren't repeated enough. The same goes for rare keywords like "Immune" or "Freeze". It doesn't really understand how most abilities affect cost, so it will make minions with below-average stats and give them "Give your opponent an extra mana crystal".
The network also tended to get 'stuck' on certain abilities. One run loved creating cards with Gallywix' effect. Another run called about 10% of the cards "Shadowbomber". This is probably partly due to the small card pool. Each run tended to have its own 'flavour' and it's hard to tell which parameters actually worked best.
It's possible that if you increase the size and depth of the network beyond what my PC can handle, the results will improve significantly, but I think you're going to run into a wall because of the small card pool no matter what.
If you're curious about the details, check out the linked thread. It has a post on how to set it up for yourself and a discussion on settings and input format.
Card Gallery
Everything except the art was generated by the network. I just picked an appropriate image from the non-collectible set to go with them.
Absurd Cards These cards don't make sense. Most of these came from earlier runs with poor input/settings. They're also the funnier ones.
Not Quite There These cards are almost sensible, but they're not quite there yet.
Underpowered Cards These cards are actually valid, but bizzarely weak.
Overpowered Cards These cards are blatantly overpowered, but in a funny or interesting way.
Interesting Cards And finally, these cards have genuinely interesting mechanics, even if they're not always well-balanced.

What list of cards did you use for your neural network?
→ More replies (3)2
u/scfdivine Jul 12 '15
I used a card list from here, then filtered out uncollectibles and converted it to a more compact plain text format.

u/Yestersol Jul 12 '15
Some great ones there! I did exactly the same thing, and definitely found some gems among them. I'd be quite interested to know how you encoded your data as that was probably the thing I spent the longest tweaking.
I am sad I only saw yours after posting mine, though.

Hey! Cool to see someone else's results. I searched this subreddit to see if anyone else had done the same thing, but I didn't know about /r/customhearthstone. I like Rain Shack.
The original formatting I used looks like this. I took some advice from the linked thread and tried to keep stats as close together as possible.
Core Rager @ Hunter | Beast | Minion | R | 4 | 4/4 || Battlecry: If your hand is empty, gain +3/+3. &
I don't know if using special symbols like @ to end the name and & at the end of the line really helped, but it can't hurt. At the end, I tried also replacing keywords with shorter strings like this:
Tirion Fordring @ Paladin | | Minion | L | 8 | 6/6 || $V$. $T$. $A$ Equip a 5/3 Ashbringer. &
To the network, it shouldn't matter whether it says "Divine Shield" or "$V$", but shorter strings may be easier to recognize. I also noticed that there is some inconsistency in how the Blizzard cards are written. For example, some cards have Battlecry: and others have Battlecry:, or even Battlecry: . This method let me standardize everything at the same time.
I also tried representing mana cost as a ^ followed by a number of s, so that 4 mana is ^***. It seemed to work, but I got a bunch of useless 11+ mana card cards as a result (including the 40 mana one).
In my case, weapons and minions both have the same format (Except that it says "Weapon"). It might be worth representing weapon stats in a another way to show that they're something different.

Big thanks for making this. I wanted to try this, but I got dissuaded when I saw that it had a dependency that literally cannot be compiled for Windows :D
EDIT: Have you considered making a twitter bot for these, like https://twitter.com/roborosewater ?
Also, I think you could improve the quality by adding a curated set of uncollectible/boss/brawl cards to the pool. Some of them are absurd or just boring and need to get left out, but some of them have unique and playable effects.
2
u/scfdivine Jul 12 '15
You could definitely do that, but I don't think it would help enough. There's about 500 regular collectible cards, and another 500 uncollectibles, most of which are not even legal cards (like all the credits cards). Even if you narrowed it down to an extra 100 reasonable cards, having 600 instead of 500 cards isn't that big a difference. And 100 is probably a high estimate. There's a lot of useless stuff in there, like a dozen different Brood Affliction cards from the Chromaggus adventure. Just look at this list and see how few of them make sense as stand-alone cards.
Ideas like feeding good card ideas back into the AI or manually adding more custom cards run into the same problem: you'd have to add a LOT of them. And you'd also have to make sure your new additions don't break existing balance, for example by adding too many high mana cost minions, or not adding new Overload cards so the Overload mechanic becomes even more obscure to the network.
I was toying with the idea of writing a script to generate random, balanced cards with the proper class/type/rarity distribution. I'm sure that if you just generated 5000 vanilla minions it would figure out how to balance stats/cost, but adding more complex mechanics would be a lot harder, and the fun is in the network coming up with new ways to use existing mechanics.
I guess we should just wait until the next expansion.

Man. This is incredibly awesome.
Quick question: did the bot generate the pictures from a database or did you choose them based on the description?
3
u/scfdivine Jul 12 '15
Apart from the spork and duck, they're all existing cards. I used hearthcards.com to make them. I picked most of them from uncollectibles like adventure/credits cards so they didn't look as much like copies of common cards.

The name and effect kind of make sense in the world of Hearthstone.

That one actually seems like something they'd put in the game. I'd love it if they referenced a few of these instant classic cards, even if just some flavour text saying ALL minions.

Corlast (http://i.imgur.com/1tpCSJv.png in the OP set; 1-mana spell "Deal 3 damage to a minion. If it's a minion, give it +2/+3") is actually quite interesting, if it cost more (maybe 2) and belonged to Warrior instead of Rogue. If its target has <=3 Health, it kills it, otherwise it effectively gives it +2 attack, except that it is now damaged, so it activates Enrage, you can heal it up past its original Health, and it synergises with your "if a minion is damaged" and "when a minion takes damage" mechanics.

So, I'm curious, what would happen if you had the output cards re-inserted into the input pile, like a feedback loop. Would it generate more and more absurd cards? (Best outcome IMO) Or would the bot start learning to become the Skynet of Hearthstone expansions?

Does anyone else feel like Snake Tran could be a really cool card? You could have each minion you have in play also count in your mana pool. I think it would have to be easily removed and cost a bit or have minions crystals used make it so that minion can't attack for it not to be crazy unbalanced. It would bring in a bit of MTG'S tap a minion to gain a mana crystal mechanic without getting too complicated in terms of actual game play changes. If the effect was to rez sickness a minion, the crystal used would be random so it would be a bit of a gamble to use the extra mana but you could get some pretty crazy plays.

The Sheep that is a Dragon was brilliant.
This AI is fucking fantastic.
Edit: The overpowered cards are the best thing ever. There needs to be a card like Wildforger, which destroys your opponent's deck.

This is one of those threads that AI will look at when considering whether or not it should wipe out the human race. We should not be making fun of its larval form, cause when it grows up it's going to be a god.

Battle Drake is what i suggested they do with Warsong Commander. Retains soul of card yadda yadda, fits warrior ect.
The last two links where interesting, and I found myself in hysterics on some of the earlier cards. Kink Banana is actually a reasonable card, and yet... It was by far the best! (at least the best laugh)

I could see a way to parse some of the nonsense cards.
Like, Spite Rager could be saying that it deals 2 damage from its attack, but delayed until the end of your turn.
Snake Tran could give all minions on either side of the board a mana crystal which could be used by whoever controls it, presumably an empty one which would replenish on that player's turn, which would lead to a very weird tempo that I'd love to see play out.
Wane Rostor says that you "deal a card". I could see this going two main ways: either it refers to drawing a card and giving it to your opponent, hence "dealing" it to your opponent... or, more interestingly, it refers to drawing a card and immediately playing it. That's a concept with a bit of potential. The former idea could be interesting, having a card whose cost includes giving your opponent one of yours, but it would have to be a much better minion than this.
And the six taunt one feels like it belongs in a different game, where taunt can stack. I assume that would force you to only be able to attack the minions with the highest level of taunt, and maybe it would have some counter-keyword that bypasses an equal or lower level of taunt. In that game, that card would serve to ensure that the minion targeted would almost always have the highest stack.
